Dongre, Dr. Latesh Malik, Class Imbalance Problem in Data Mining: Review, International Journal of Computer Science and Network (IJCSN), Volume 2, Issue 1, February 2013, ISSN 2277-5420 doi.org/10.48550/arXiv.1305.… 【概要】 医療診断での希少疾患の予測や、ネットワークの侵入検知、銀行の不正取引検出など、現実の多くのアプリケーションでは、一方のクラスのサンプル数が他方よりも圧倒的に多い「不均衡データ」が発生します。 例えばがん細胞の検出において、正常細胞を誤分類しても追加検査で済みますが、がん細胞を見逃すと深刻な健康リスクにつながります。 しかし、従来の機械学習アルゴリズムは全体の分類精度を最適化しようとする設計上、重要な少数派データを無視して多数派として誤分類してしまう傾向があります。 本論文は、この問題を解決するための既存手法を3つのカテゴリに分類し、それぞれの長所と短所を整理しています。 【アプローチ1：データサンプリング（前処理）】 データセットの分布自体を人工的に再サンプリングしてバランスをとる手法です。 ・アンダーサンプリング：多数派クラスのデータをランダムに削除してバランスをとる手法（Random Under-samplingなど）ですが、貴重な情報が失われる問題があります。 ・オーバーサンプリング：少数派クラスのデータを複製または新規に合成して増やす手法（SMOTEなど）ですが、学習プロセスにより多くの時間がかかるようになります。 【アプローチ2：アルゴリズム的アプローチ】 分類アルゴリズム自体を修正して、未知のデータに対するパフォーマンスを最適化する手法です。 ・コスト考慮型学習（Cost-sensitive learning）：すべての誤分類コストを均一とせず、少数派クラスを誤分類した際のペナルティ（条件付きリスク）を重く設定し、これを最小化するように学習します。しきい値移動（Threshold-moving）を用いて、出力しきい値を低コストのクラスに向けて移動させるアプローチも有効です。 ・カーネルベース学習：サポートベクターマシン（SVM）などのアイデアを活用し、不均衡データを高次元空間にマッピングして処理します。 【アプローチ3：特徴選択（Feature Selection）】 高次元データセットにおいて、分類器が最適なパフォーマンスに到達できるような特徴のサブセットを選択します。 クラスの不均衡問題はデータの高次元性の問題と同時に発生することが多いため、サンプリングやアルゴリズムの調整だけでは不十分な場合に不可欠なステップとなります。 【各アルゴリズムの比較検討】 論文内では既存のアンサンブル手法やアルゴリズムが詳細に比較されています。 ・RUSBoost：データサンプリングとブースティングを組み合わせたハイブリッド手法で、SMOTEBoostよりもシンプルで高速ですが、多クラス不均衡問題には対応できません。 ・AdaBoostNC：多クラス不均衡データセットに使用され、少数派の予測精度は向上しますが、分類器全体の性能が無視される傾向があります。 ・Infinitely imbalanced logistic regression (IILR)：主に2クラス分類に使用されますが、外れ値の数にパフォーマンスが依存します。 ・DCIL-IncLPSVM：動的なクラス不均衡を伴うデータストリームを処理するために提案された手法ですが、サンプルの分布自体は考慮されません。 ・Boosting SVM：少数派サンプルの予測におけるSVM分類器の性能を向上させますが、クラス分布の不均衡は無視されます。 【まとめ】 クラス不均衡問題の解決策は、実験に使用されるデータの性質に大きく依存するため、単一の完璧な解決策は存在しません。 ただし、データの追加や削除によってバランスを整えるデータ前処理や、弱学習器の性能を向上させるブースティング（RUSBoostなど）は強力な手段となります。 結論として、サンプリング手法とアルゴリズム的アプローチなど、2つ以上の技術を組み合わせた「ハイブリッドアプローチ」を採用することが、クラス不均衡問題を解決するための最良の方向性であると示唆しています。
